It’s a huge area. It’s all about predicting future demand and volume to make sure you’re producing what your customers actually need. You're not just looking at past sales, either. You’re pulling in historical data, current market trends, and anything else you can find that might affect what you’re making.

And the real trick is to not just be predictive, but to be prescriptive.

That’s what takes predictive analytics to the next level. It’s not just, "Here’s what’s going to happen." It’s, "Based on what’s going to happen, here’s what you should do about it." You’re using optimization models to recommend specific actions.

A great example of this comes from a top multinational retailer that we cooperated with. Their main goal was basically a near-zero waste system, especially with perishables. They built a model to predict what people would buy and how much, so they didn't end up with more on the shelves than they needed before the expiration date. 

It was a really interesting model because it was so complex. For example, bottled water consumption is totally different on a hot day. So the model had to be built-out with factors that seemed completely unrelated to the store itself, like the weather forecast. It’s that whole "keep minimal inventory" approach, just-in-time delivery, but factoring in all these seasonal and geographic variables.

Unfortunately, you can't be. Every machine learning project is very specific to the company and the domain. That's mainly because if you're not using some generic, off-the-shelf model and you want to truly train it, you have to use your own company’s data. And that data can be either prepared, or not prepared. These projects are always going to be highly specific to a single company. 

Production planning 

Production planning is a classic challenge for any manufacturer. It's about figuring out how much of a product to make, where to make it, and when. You have to be able to hit a moving target, i.e., market demand while keeping costs down, staying flexible, and getting orders out on time. The real pain point is that demand is never static; it's always fluctuating due to seasonality and a million other factors.

And your resources aren’t infinite, either. You’re always up against limited equipment and personnel. The whole game is to find the perfect balance: maximize how you use your facilities and people, cut product costs, minimize downtime, and still meet your deadlines. It's an optimization puzzle.

This is exactly where decision optimization comes in. It's a form of prescriptive analytics that finds the absolute best way to use all your resources – your raw materials, your people, your machines – to hit your profit goals.

For example, look at what Continental Tires did. They used a decision optimization solution to fine-tune production across twenty of their plants. The whole point was to get rid of bottlenecks and ensure they were making the best possible use of their materials, their staff, and their machine capacity. Those schedules don’t sit in isolation but flow right into ERP, logistics, or BI systems and adjust as conditions shift being in line with up to date demand for the facility and other planned maintenance activities.

Also, bear in mind that manufacturers can decide which insights to keep in the cloud for long-term planning and which to process instantly on the machine to prevent small issues from escalating. 

For example, Canon Production Printing, whom we work with, detects in real time when a printer nozzle clogs. Neighboring nozzles immediately adjust ink streams to compensate, and ensure flawless print quality. The end user of the device never even notices. For me, it’s a genius approach. It’s a clear example of how companies can use built-in mechanisms to minimize maintenance occurrence.

Quality control 

A lot of quality control (still) comes down to final inspection. You find out you made a bad product after you've already made it. But with predictive analytics, you're not reacting to a problem – you're stopping it before it starts. The system uses statistical analysis and machine learning, looking at all your real-time data to find the hidden patterns and clues that point to a potential defect.

The sheer amount of data here can be a massive advantage. You've got sensors, quality checks, and production metrics all generating a constant stream of information. The tools process all that data to forecast quality outcomes and identify risk factors. 

Think about this – a system can analyze the temperature and pressure from a sensor during a production run and then forecast whether those final products will meet your quality standards. If conditions start to drift outside the sweet spot, it alerts you before a single bad part rolls off the line. For example, it can spot an anomaly, like a sudden vibration spike in an assembly line motor, before it causes a product defect. 

What's the real power here? It's how it combines historical data with real-time monitoring to solve these huge pain points. A model might analyze thousands of inspection reports and learn that a combination of high humidity and a certain machine speed strongly correlated with defects. Over time, it can spot that risk earlier and more reliably than any traditional check ever could.

While predictive analytics brings tangible business benefits in manufacturing, there are a few challenges that you might come across along the way:

Poor data consolidation and siloed systems

This is, arguably, the most universal challenge, i.e., one that always comes up in client conversations. You have all this great manufacturing data coming from multiple sources – your ERP, your Manufacturing Execution System, and a growing number of IoT sensors. But the issue is these systems often don't communicate well and/or their outputs are not unified.

So, how do you make sure the data from all those different sources is consistent and reliable before you use it in your predictive models? It doesn't happen “magically”. You need an analyst on the case.

For example, imagine a system that collects temperature data. In one database, you've got Celsius, and in the other, Fahrenheit. The same could be said about pressure – one source will use Pascal (Pa) units, while others might go with Pressure per Square Inch (PSI) or Atmosphere (Atm). Someone must be there to consolidate that.

On top of that, these systems can have completely different time intervals. One system sends data every hour, while another sends it every five minutes. This creates gaps that you have to figure out how to bridge. Do you wait for the hourly data or do you use the five-minute data from earlier? 

The right answer really depends on your business. It's like in economics; you look at year-over-year data, not just month-to-month, because you need to account for seasonal dependencies. You need to know your domain.

The legacy ghost in the “machine”

This challenge gets even bigger when you try to integrate with legacy systems. New sensors are designed to send data constantly – every second, for example. But older ERP systems often don't have the functionality to push out events, which means they can't tell other systems that something just happened.

When a system can't push out events, your data consolidation is weak. And sometimes you wonder if the only option is to abandon the legacy system entirely. But here's the problem with that: you lose crucial data points

Let’s go back to the above-mentioned supply chain forecasting use case. You could have all the real-time weather data from your IoT sensors, but if you don't have access to your sales data – the invoices and receipts from your ERP – you're missing the most basic business information. You have weather trends, sure, but you don't have a clue what people are actually buying.

And because these older systems often process analytical data just once a day, usually overnight, you lose the ability to react in real time. You can't respond to a sudden event – say, a new country lockdown sending everyone to your store to stock your products. You might not know about the spike in demand until the next day when the data is finally processed, and by then, the opportunity for a quick response might be gone.

How to solve this challenge 

It takes a skilled analyst or an analytics-driven team to make sense of the data. Systems can have different units or send data at varying intervals, creating gaps that need careful thought. Ultimately, the best approach depends entirely on your domain, and an analyst must decide which method is best for your specific business.

The amount of data and its cost

There’s a massive logistical reality to all this: the sheer volume of data and the costs that come with it. I've been on a project with 30,000 servers, and they're all sending data about memory usage, CPU, and fan speeds every single second. When you do the math, that's an enormous amount of data points every day, terabytes every month. So, for one thing, just storing & processing all of that data as well as running your machine learning models on it is a significant expense. You also have to pay extra attention to cleaning the data because there are always anomalies or incorrect values, which will eventually lead to further costly recalculations. For smaller companies, these costs can be a huge obstacle.

This brings us back to that legacy system challenge, but with a new twist. For a project with a client, they wanted a platform that could send real-time data on inventory levels and prices. But, as a data engineer, I can't just go in and change their point-of-sale system. It wasn't built to be event-based, so it can't push out data when a transaction happens. Our solution? We have to poll the system – in other words, we have to ask it for data constantly, say, every minute – luckily, we were able to capture only the altered values and not the entire dataset with each run.

Even in our optimistic scenario, the risk here is that you might "kill" the system's performance. A frequent query from an outside system adds a significant load on top of the transactions it’s already processing. So you have to find a balance between the speed of your reaction and the danger of overloading that legacy system. Do you poll every minute, every five minutes, or every ten? It’s a trade-off that requires careful consideration.

How to solve this challenge

Ultimately, there's no single magic solution. The key is to find the right mix of reaction speed and system performance. Your IT partner or analyst with deep domain knowledge must decide how frequently to poll legacy systems, carefully weighing the need for real-time data against the risk of degrading the system's performance.

Securing ROI from predictive analytics

We talked about ROI before, but it’s worth digging into it because it’s a huge barrier for a lot of organizations. The investment in AI and analytics is significant. We're talking about major money for the technology, the infrastructure, and the specialized talent you need to even get it off the ground. It’s tough to justify that cost when the returns aren’t immediate. A lot of companies, especially smaller ones, just get cold feet.

And it’s a chicken-and-egg problem. We know from a Forrester study that companies lose millions every year just from bad data. That’s even before they try to do anything with it. So, you have to invest in data quality, which is part of the ROI calculation for predictive analytics, but you can’t show the value until you actually build the models. It’s hard to convince someone who already has a team of experienced people that a model can do it better.

Think about a complex use case, for example, a combined heat and power plant like the ones we often have in Poland. You've got different types of generators for heat and electricity, plus energy storage. They're constantly deciding whether to generate power, store heat, or convert one to the other, all while keeping an eye on the price of gas, coal, and electricity. It's a serious optimization problem because there are so many variables and physical constraints. You can’t just turn a boiler on and off without it breaking down. That’s why you need these kinds of advanced models.

The challenge with models 

And this leads to another challenge – the models themselves are never perfect on the first try. You might build something that's 90% accurate, but to get to 95%, you realize you need to factor in some completely new data set, like logistics or weather. Every time you do that, the cost and timelines could be affected, which creates moments of doubt for the client. It’s why some of these projects require a real "leap of faith." A client might try a standard, "boxed" solution first, and when it fails to deliver, they have to decide whether to take on a riskier custom project.

Overcoming technical hurdles 

A separate but related challenge is processing data from sensors, especially with edge computing. With so much data coming in, you can't always send it all to the cloud and wait for a response; the latency is too high. So you have to process it locally, but that hardware has limited memory and processing power.

One of the possible approaches is something called model distillation. It's the process of taking a massive, complex model and "distilling" it down into a much smaller, more efficient, domain-relevant version that can run on-site. Think of it like taking a model the size of GPT and shrinking it so it can fit on a smartphone while still being functional.

Don’t get me wrong, model distillation is not a silver bullet – it’s not as simple as “smaller = better for edge”. Reducing the model size can reduce accuracy, increase brittleness, and, sometimes, change the kind of errors you get. And it’s not always easy to distill without losing parts of the teacher’s behavior, especially for more complex tasks or out‑of‑distribution data. But together with techniques like pruning, quantization, and optimization of the network architecture, it can result in the desired outcomes. It’s about finding the right balance between performance and size.

How to solve this challenge

The key to securing ROI is managing expectations from the start. You need a partner who can help decide what data to process locally and what to send to the cloud, reducing costs and latency. This partner must also guide you and help you understand that models require an iterative process of refinement and that the optimal return comes after the initial investment and experimentation.

Getting buy-in from users

It’s one thing to get ROI on paper, but a completely different thing to get buy-in from the people on the factory floor. The engineers who've been working with these systems for decades have a "gut feeling" that tells them what’s going on. It’s hard to convince them that a new predictive model is better. Initially, the system might have some failures, and that's all it takes for an experienced engineer to say, "What's the point?"

And sometimes the technology itself is the first problem. Take some polymer reactors and plastic extruderssome polymer reactors and plastic extruders, for example. The temperature inside is so high that usually only specialized sensors can withstand it – and while many of these older machines do have basic sensors, they weren't designed to connect easily with modern data platforms or IoT solutions. Retrofitting them for real-time monitoring and integration is often a significant challenge.

That's the technical side of the coin, but the human side is just as important. I remember a project we audited in the oil and gas industry. This other vendor had created a beautiful, tablet-based solution with great charts and prompts. It looked perfect. The only problem? No one talked to the end users. The workers wore thick gloves on the job and couldn't operate the touch screen. Their old systems had big buttons and keyboards for a reason. It didn't matter how beautiful or smart the analytics were; if the user can’t actually use the system, it's a complete failure.

How to solve this challenge

To get buy-in, you must involve the end-users from the very beginning of the design process. By collaborating with the people on the factory floor, you ensure the solution not only provides accurate insights but is also practical and intuitive for their daily workflow.
